Short answer: Automatic Prompt Engineer (APE) treats prompt optimization as a search problem over natural language space: a generator LLM proposes candidate prompt instruction variants, an evaluator LLM scores candidates against a benchmark dataset, and Monte Carlo search / evolutionary selection refines the highest-scoring prompt.

Detail

Human-written prompts are rarely optimal for downstream accuracy. APE automates prompt discovery.

APE Algorithm Loop

  1. Instruction Proposal: Given exemplar input-output pairs, prompt a generator LLM: "Generate a system prompt that maps these inputs to these outputs."
  2. Scoring: Run candidate prompts across NN test cases and score accuracy using log-likelihood or LLM-as-a-Judge.
  3. Resampling / Mutation: Mutate high-scoring candidate strings by proposing semantic paraphrases until validation score converges.

Example

Python concept illustrating APE search loop:

python
def ape_search_loop(candidate_prompts: list[str], eval_dataset: list[dict]) -> tuple[str, float]:
    best_prompt = ""
    best_score = -1.0

    for prompt in candidate_prompts:
        score = 0
        for item in eval_dataset:
            # Simulate prompt scoring against ground truth
            predicted = f"Simulated output for {item['input']}"
            if item['ground_truth'] in predicted:
                score += 1

        acc = score / len(eval_dataset)
        if acc > best_score:
            best_score = acc
            best_prompt = prompt

    return best_prompt, best_score

Interview tips

  • Mention DSPy (Declarative Self-improving Language Programs) as the industry standard implementation of automated prompt optimization principles.
  • Discuss how APE often discovers counter-intuitive phrasing that outperforms human-engineered prompts by 10-15%.
